Amazon AI Researchers Open-Source ‘Syne Tune’: A Novel Python Library For Distributed HPO With An Emphasis On Enabling Reproducible Machine Learning Research

Deep learning models with billions of parameters are trained through gradient-based stochastic optimization, thanks to powerful algorithms, systems, and hardware advancements. These algorithms include several hyperparameters that are essential for effective performance. Hyperparameter adjustment is required to control the behavior of a machine learning model. If our hyperparameters are not correctly set, our anticipated model parameters will not minimize the loss function, resulting in poor results. The lousy result suggests that our model has further faults. In actuality, the accuracy or confusion matrix will be worse.

Many hyperparameters exist like learning rate, regularisation type, degree, and size of neural network layers. Automating the setting of these hyperparameters and accelerating the training of neural network weights are necessary if domain experts and industry practitioners benefit from the most recent deep learning technologies. Even for specialists, tuning them takes a lot of time and effort; choosing the best hyperparameter configuration frequently depends on factors like cost or latency.

To tackle this problem, researchers at AWS introduced Syne Tune, a library for distributed, large-scale hyperparameter optimization (HPO). The modular design of Syne Tune makes it simple to add new optimization algorithms and swap between various execution backends to support experimentation. For large-scale assessments of distributed asynchronous HPO algorithms on tabulated and surrogate benchmarks, Syne Tune offers an effective simulator backend and a benchmarking package that promotes repeatable benchmarking. On well-known benchmarks from the literature, we demonstrate these features using a variety of advanced gradient-free optimizers, including multi-fidelity and transfer learning techniques.

Two use scenarios illustrate the benefits of Syne Tune for restricted and multi-objective HPO applications: the first considers hyperparameters that result in suitable solutions. At the same time, the second automatically selects machine types in addition to the common hyperparameters.

The following are Syne Tune’s primary characteristics:

• Broad coverage of baselines: Syne Tune implements various HPO techniques, including evolutionary search, Bayesian optimization, and random search, eliminating implementation bias from comparisons.

• Backend-neutral: Syne Tune makes it simple to change the execution backend. New backends can be incorporated because they come with a generic API.

• Advanced HPO methodologies: Syne Tune offers a variety of advanced configurations, such as hyperparameter transfer learning, limited HPO, or multi-objective optimization

• Benchmarking: Syne Tune offers a benchmark API and a massive collection of benchmark implementations. With tabular or substitute benchmarks and a simulation backend, a specific focus is placed on allowing quick, manageable experimentation.

On GitHub, SyneTune is offered as a package. This package offers advanced distributed hyperparameter optimizers (HPO), which allow trials to be assessed using a variety of trial backend choices. One can choose between a local backend to evaluate trials locally, SageMaker to evaluate trials as separate SageMaker training jobs, or a simulation backend to benchmark parallel asynchronous schedulers quickly.

Syne-tune package can be installed using the pip command.

pip install syne-tune

Syne Tune offers the potential to improve the efficacy, dependability, and credibility of automated tuning studies. It enables researchers without significant compute resources to participate by elevating simulation on tabulated benchmarks to first-class status.
